I think he came across the Cosmic Cube on his own. The Gauntlet he needed the Infinity Well, so you're right there.

Thanos is also thousands of years old. And with his prep, he's become God twice and threatened the entirety of the universe another time. He managed to absolutely own Galactus and The Hunger (a dimension-eating entity) with...a few hours of prep.
Thanos' prep outclasses nearly anyone save perhaps Darkseid and Metron.

Show me one impressive thing Thanos has done with prep under his own power. no outside power ups. no stealing stuff. no tricking. Just str8 prep. with his own resources. No stealing dna or anything like that.
